I can see what the pdf version looks like in a pdf viewer, but when I try to open up the same file or the corresponding svg file in Inkscape, there's a lot of colors and details missing. Any ideas what might be causing this?

After studying the image, I think it might be one specific 'layer' although I'm only seeing one layer, and the fact that this is the 'shadow' layer for the details and it is just coming through as gray instead of some other color with opacity settings.

Where did the corresponding svg file come from.
Also what operating system are you using - there are some other small programs that may help dealing with difficult pdfs
It came from a designer I was working with. I'm on Windows 10.
It's possible the objects could be in a different order.

See if a deep ungroup has any effect
Edit>Select all in layers, then Extensions>arrange>deep ungroup. Worth a try as it takes no time.

The ability of Inkscape to handle PDF is very limited especially when those PDF are generated by Adobe products...
